PhaseSAE (Time-Division Multiplexed SAE)

Live

Time-Division Multiplexed Dictionary Learning for LLM Mechanistic Interpretability. Partitions astronomical SAE dictionaries into cascaded phase tiles, cutting peak memory bandwidth by 1/P while achieving +65.9% higher downstream Cross-Entropy loss recovery than monolithic Top-K.

Problem

Standard monolithic SAEs evaluate astronomical dictionary spaces (e.g. 262k latents) instantaneously, creating a severe memory-bandwidth wall (0.5 FLOP/byte arithmetic intensity) during autoregressive token generation where GPUs sit >99% idle dragging gigabytes of weights from HBM to SRAM.

Business & Systems Impact

  • +65.9% relative gain in downstream Cross-Entropy loss recovery (40.51% vs 24.42% for Top-K baseline on TinyStories-1M)
  • +65.7% relative gain in Explained Variance R² (0.2913 vs 0.1758)
  • Strict 1/P (4× for P=4) reduction in peak active parameter memory bandwidth footprint
  • Monotonic residual error contraction (41.5% → 71.0% → 84.0% → 90.5%) enabling 50–75% adaptive latency reductions via Anytime early-exit
  • Production-grade implementation with 6/6 tests passing in standalone reference library and 11/11 tests passing in SAELens integration fork

Solution Architecture

Engineered PhaseSAE using Time-Division Multiplexing (TDM) and thalamocortical phase-multiplexing principles. Partitions dictionary tensors into P orthogonal phase tiles, evaluates cascaded micro-ticks against progressive residual errors, eliminates greedy feature interference, and introduces Anytime early-exit inference.
